What is hybrid search in a RAG system?

Hybrid search combines semantic search (vector similarity using embeddings) and keyword search (BM25 lexical matching) to retrieve relevant documents before generating responses. Results are merged using techniques like reciprocal rank fusion, then re-ranked. This approach provides both conceptual matching and exact term precision, such as finding policy documents about “privileged access” while also matching the exact code “AUTH-403-PRIV.”

Is semantic search alone enough for enterprise RAG?

No. Semantic search works well for paraphrases and natural language queries but often misses exact matches on IDs, error codes, and regulatory citations. For example, when a user searches for “GDPR Article 28(3)” or “SKU-PRO-X500,” semantic search may return loosely related content instead of the precise document. Keyword search should be included as a minimum baseline for production-grade systems.

When does keyword search outperform semantic search in RAG?

Keyword search performs better for error messages, version numbers, product codes, legal clauses, and queries where exact terms are critical. For instance, a support engineer searching for “NullPointerException at line 143” needs exact lexical matching. Keyword search also delivers deterministic and auditable results that compliance teams can verify.

How do I know if my retrieval quality is good enough?

Measure retrieval quality directly rather than relying only on final answers. Use metrics such as Hit Rate @k, Mean Reciprocal Rank (MRR), and Normalized Discounted Cumulative Gain (NDCG) on a labeled query dataset. Evaluate whether the authoritative source appears within the top results, such as the top five. Many teams discover significant retrieval gaps when they first conduct structured evaluations.

Do I still need fine-tuning if I use a strong hybrid retrieval pipeline?

In many cases, no. Strong retrieval pipelines, improved prompts, and re-ranking strategies can significantly enhance performance without fine-tuning. Fine-tuning is typically required for domain-specific behavior, stylistic adjustments, or specialized reasoning. For enterprise factual accuracy, improving retrieval and content chunking strategies often provides better returns.

How can I improve retrieval accuracy without changing the LLM model?

Focus on optimizing the retrieval layer. Implement hybrid search if currently using vector-only retrieval, add cross-encoder re-ranking for measurable accuracy improvements, refine content chunking strategies, apply metadata-based filtering, and establish a structured retrieval evaluation framework. These improvements often outperform model upgrades for enterprise knowledge retrieval tasks.
